Curse of Dimensionality

The curse of dimensionality refers to the collection of phenomena that arise when analyzing data in high-dimensional spaces. For statistical learning in finance, where risk factors, predictors, and asset cross-sections can number in the hundreds or thousands, these phenomena impose fundamental limits on what can be learned from data.


Geometric Origins

Volume Concentration

Consider a \(d\)-dimensional hypercube \([0,1]^d\) and an inscribed hypersphere of radius \(r = 1/2\).

Volume of hypersphere:

\[ V_d(r) = \frac{\pi^{d/2}}{\Gamma(d/2 + 1)} r^d \]

Ratio of sphere to cube volume:

\[ \frac{V_d(1/2)}{1^d} = \frac{\pi^{d/2}}{2^d \Gamma(d/2 + 1)} \xrightarrow{d \to \infty} 0 \]

Implication: Almost all volume in a hypercube concentrates in the corners, far from the center. Data points are sparse relative to the space they inhabit.

Distance Concentration

For points uniformly distributed in \([0,1]^d\), the expected distance to the nearest neighbor grows with dimension.

Theorem. Let \(X_1, \ldots, X_n \sim \text{Uniform}([0,1]^d)\) i.i.d. For any point \(x\):

\[ \mathbb{E}[\min_{i} \|x - X_i\|] \asymp n^{-1/d} \]

For fixed \(n\) and large \(d\), typical nearest-neighbor distances approach the diameter of the space.

Concentration of Pairwise Distances

Theorem (Distance concentration). Let \(X, Y\) be independent uniform on \([0,1]^d\). Then:

\[ \frac{\|X - Y\|^2 - d/6}{\sqrt{d \cdot \text{Var}(\|X-Y\|^2)}} \xrightarrow{d} \mathcal{N}(0,1) \]

All pairwise distances concentrate around \(\sqrt{d/6}\). When all points are equidistant, notions of "near" and "far" lose meaning.


Statistical Consequences

Nonparametric Convergence Rates

Recall Stone's theorem: for functions in the Hölder class \(\mathcal{H}(\beta, L)\), the minimax rate for estimating \(f\) in \(L_2\) is:

\[ \inf_{\hat{f}} \sup_{f \in \mathcal{H}(\beta, L)} \mathbb{E}\|\hat{f} - f\|_2^2 \asymp n^{-\frac{2\beta}{2\beta + d}} \]

Effective Sample Size

Define effective sample size as the number of observations needed in dimension 1 to achieve the same error as \(n\) observations in dimension \(d\):

\[ n_{\text{eff}} = n^{\frac{2\beta + 1}{2\beta + d}} \]

Example. For \(\beta = 2\) (twice differentiable) and \(n = 1000\):

With 1000 observations in 50 dimensions, effective information content is equivalent to ~1.5 observations in one dimension.

Required Sample Size

To achieve a target MSE of \(\varepsilon^2\), the required sample size scales as:

\[ n \asymp \varepsilon^{-(2\beta + d)/\beta} \]

For small \(\varepsilon\) and large \(d\), this grows exponentially in \(d\).

Covering Numbers and Complexity

The covering number \(\mathcal{N}(\varepsilon, \mathcal{X}, \|\cdot\|)\) is the minimum number of balls of radius \(\varepsilon\) needed to cover space \(\mathcal{X}\).

For \([0,1]^d\):

\[ \mathcal{N}(\varepsilon, [0,1]^d, \|\cdot\|_\infty) = \lceil 1/\varepsilon \rceil^d \]

This exponential scaling implies that learning algorithms must query exponentially many regions to approximate functions uniformly.


Implications for Learning

Local Methods Fail

k-Nearest Neighbors. To capture local structure with \(k\) neighbors, the neighborhood radius is:

\[ r_k \approx \left(\frac{k}{n}\right)^{1/d} \]

For fixed \(k/n\), \(r_k \to 1\) as \(d \to \infty\)—the "local" neighborhood spans the entire space.

Kernel Regression. With bandwidth \(h\), the effective number of observations in a ball of radius \(h\) is:

\[ n_{\text{local}} \approx n \cdot h^d \]

To maintain constant \(n_{\text{local}}\) as \(d\) increases, we need \(h \to 1\), destroying locality.

Empty Space Phenomenon

Theorem. For \(n\) points uniformly distributed in \([0,1]^d\), with high probability there exists an empty ball of radius:

\[ r \asymp \left(\frac{\log n}{n}\right)^{1/d} \]

For large \(d\), this radius is close to 1—large empty regions exist even with many observations.

Implication for finance: Extreme market scenarios (crashes, regime changes) may lie in empty regions of the feature space where no historical data provides guidance.


The Concentration of Measure Phenomenon

Gaussian Concentration

For \(X \sim \mathcal{N}(0, I_d)\), the norm concentrates:

\[ \frac{\|X\|^2 - d}{\sqrt{2d}} \xrightarrow{d} \mathcal{N}(0,1) \]

Most probability mass lies in a thin shell of radius \(\sqrt{d}\):

\[ \mathbb{P}\left(\left|\|X\| - \sqrt{d}\right| > t\right) \leq 2e^{-t^2/2} \]

Implications for Gaussian Models

In factor models \(R = B F + \varepsilon\) with \(F \sim \mathcal{N}(0, I_k)\): - Factor realizations concentrate on a sphere - Extreme joint movements of many factors are exponentially rare - Tail risk estimation requires extrapolation beyond observed data


Financial Manifestations

Cross-Sectional Asset Pricing

With \(n\) assets and \(k\) factors, the factor loading matrix \(B \in \mathbb{R}^{n \times k}\) has \(nk\) parameters.

Modern asset pricing: - \(n \approx 5000\) stocks - \(k \approx 5-10\) traditional factors, or \(k \approx 100+\) characteristics

Even with 50 years of monthly data (\(T = 600\)): - Parameters to estimate: \(nk = 500,000\) (for \(k = 100\)) - Observations: \(nT = 3,000,000\) - Parameters per observation: \(nk/(nT) = k/T \approx 0.17\)

The problem is high-dimensional despite many observations.

Option Pricing and Greeks

An option's value depends on: spot \(S\), strike \(K\), maturity \(T\), volatility surface parameters (potentially infinite-dimensional), interest rates, dividends...

Calibrating a local volatility surface \(\sigma(S, t)\) on a \(50 \times 50\) grid requires 2500 parameters from typically \(<1000\) liquid option prices.

Portfolio Optimization

The mean-variance problem requires estimating: - \(n\) expected returns - \(n(n+1)/2\) covariance parameters

For \(n = 500\) assets: 125,250 covariance parameters from perhaps \(T = 250\) trading days.

Michaud's "Error Maximization": Mean-variance optimization amplifies estimation errors, often producing extreme positions in poorly estimated quantities.


Mitigation Strategies

Dimensionality Reduction

Principal Component Analysis. Project onto top \(k\) eigenvectors of covariance:

\[ X_{\text{reduced}} = X V_k, \quad V_k = [v_1, \ldots, v_k] \]

where \(v_j\) are eigenvectors of \(\text{Cov}(X)\).

In finance, the first few principal components of returns explain substantial variance: - PC1 (market): ~30-50% of variance - PC1-PC5: ~60-70% of variance

Factor models. Assume structure:

\[ R = \alpha + B F + \varepsilon, \quad \text{Cov}(\varepsilon) = D \text{ (diagonal)} \]

With \(k\) factors, covariance has \(nk + n\) parameters instead of \(n(n+1)/2\).

Sparsity and Regularization

LASSO for variable selection. If only \(s \ll d\) predictors are relevant:

\[ \hat{\beta} = \arg\min_\beta \left\{ \|Y - X\beta\|_2^2 + \lambda \|\beta\|_1 \right\} \]

Oracle inequality: Under restricted eigenvalue conditions:

\[ \|\hat{\beta} - \beta^*\|_2^2 \leq C \frac{s \log d}{n} \sigma^2 \]

The effective dimension is \(s \log d\), not \(d\).

Graphical LASSO for covariance. Estimate sparse precision matrix:

\[ \hat{\Omega} = \arg\min_{\Omega \succ 0} \left\{ \text{tr}(S\Omega) - \log\det(\Omega) + \lambda \|\Omega\|_1 \right\} \]

where \(S\) is sample covariance and \(\|\Omega\|_1 = \sum_{i \neq j} |\Omega_{ij}|\).

Structural Assumptions

Additivity. Assume:

\[ f(x_1, \ldots, x_d) = \sum_{j=1}^d f_j(x_j) \]

Estimation reduces to \(d\) univariate problems, achieving rate \(n^{-2\beta/(2\beta+1)}\) independent of \(d\).

Single-index models:

\[ f(x) = g(w^\top x) \]

reducing \(d\)-dimensional regression to estimating direction \(w\) and univariate function \(g\).

Low-rank structure: For matrix completion, assume \(\text{rank}(M) = r \ll \min(m,n)\).

Shrinkage Estimators

Ledoit-Wolf shrinkage for covariance:

\[ \hat{\Sigma}_{\text{shrink}} = (1-\alpha) S + \alpha \mu I \]

where \(\alpha\) and \(\mu\) are chosen to minimize expected Frobenius loss.

Optimal \(\alpha\) increases with dimension, reflecting greater need for regularization.

James-Stein for means: The sample mean is inadmissible for \(d \geq 3\). Shrink toward grand mean:

\[ \hat{\mu}_{\text{JS}} = \bar{X} - \frac{(d-2)\hat{\sigma}^2}{n\|\bar{X}\|^2} \bar{X} \]

Sample Splitting and High-Dimensional Inference

Post-Selection Inference

When variables are selected based on data (e.g., via LASSO), standard inference is invalid.

Selective inference conditions on the selection event:

\[ \mathbb{P}(|\hat{\beta}_j - \beta_j| > z | \text{variable } j \text{ selected}) \]

Debiased LASSO

For valid inference in high dimensions, debias the LASSO estimator:

\[ \hat{\beta}^{\text{debias}} = \hat{\beta}^{\text{lasso}} + \frac{1}{n} \hat{\Theta} X^\top (Y - X\hat{\beta}^{\text{lasso}}) \]

where \(\hat{\Theta}\) approximates the inverse of \(X^\top X / n\).

Under sparsity conditions:

\[ \sqrt{n}(\hat{\beta}_j^{\text{debias}} - \beta_j) \xrightarrow{d} \mathcal{N}(0, \sigma^2 \Theta_{jj}) \]

Random Matrix Theory Perspective

Marchenko-Pastur Distribution

When \(n, d \to \infty\) with \(d/n \to \gamma \in (0, \infty)\), the eigenvalues of the sample covariance \(S = X^\top X / n\) (for \(X\) with i.i.d. entries) follow the Marchenko-Pastur distribution:

\[ \rho_{\text{MP}}(\lambda) = \frac{\sqrt{(\lambda_+ - \lambda)(\lambda - \lambda_-)}}{2\pi \gamma \lambda} \mathbf{1}_{[\lambda_-, \lambda_+]}(\lambda) \]

where \(\lambda_\pm = (1 \pm \sqrt{\gamma})^2\).

Implication: Even if the true covariance is \(I\), sample eigenvalues spread over \([(1-\sqrt{\gamma})^2, (1+\sqrt{\gamma})^2]\).

For \(\gamma = 1\) (as many dimensions as observations): eigenvalues span \([0, 4]\), with many near zero (apparent multicollinearity from noise).

Spiked Covariance Model

If true covariance has a few large eigenvalues (factors) plus identity:

\[ \Sigma = \sum_{i=1}^k \lambda_i v_i v_i^\top + I \]

the sample eigenvalues exhibit a phase transition: - \(\lambda_i > 1 + \sqrt{\gamma}\): Eigenvalue separates from bulk, estimable - \(\lambda_i \leq 1 + \sqrt{\gamma}\): Eigenvalue absorbed into noise, undetectable

Financial implication: Weak factors (small \(\lambda_i\)) cannot be reliably estimated when \(d/n\) is not small.


Blessing of Dimensionality?

High-Dimensional Classification

Cover's theorem: In high dimensions, random binary labelings become linearly separable with high probability.

For \(n\) points in \(\mathbb{R}^d\) in general position, the probability that a random labeling is linearly separable is:

\[ P(d, n) = \frac{1}{2^{n-1}} \sum_{k=0}^{d-1} \binom{n-1}{k} \]

For \(d > n\): \(P(d, n) = 1\) (always separable).

Caution: This "blessing" is illusory for generalization—it means we can fit any training labels, including noise.

Kernel Methods

The kernel trick implicitly maps to high-dimensional feature spaces where linear methods suffice:

\[ \phi: \mathbb{R}^d \to \mathbb{R}^D, \quad K(x, x') = \langle \phi(x), \phi(x') \rangle \]

Computation depends only on \(n\), not \(D\). But generalization still depends on effective dimensionality of the problem.


Practical Guidelines for Finance

When Dimensionality Bites

  1. More predictors than observations: Direct regression infeasible
  2. Many assets, short history: Covariance estimation unreliable
  3. Model calibration with many parameters: Overfitting likely
  4. Nonparametric methods in \(d > 5\): Rates become very slow

Defensive Strategies

  1. Impose structure: Use factor models, sparsity, additivity
  2. Regularize aggressively: Err toward underfitting
  3. Reduce dimension first: PCA, variable selection, feature engineering
  4. Use economic priors: Incorporate domain knowledge as constraints
  5. Validate rigorously: Out-of-sample testing essential; in-sample metrics unreliable

The volume of a \(d\)-dimensional hypersphere of radius \(r = 1/2\) is:

The unit hypercube has volume \(1^d = 1\). The ratio is:

\[ \text{Ratio}(d) = \frac{\pi^{d/2}}{2^d \, \Gamma(d/2 + 1)} \]

For \(d = 3\):

Using the formula with \(\Gamma(15/2 + 1) = \Gamma(9.5)\). We can compute \(\Gamma(9.5) = 8.5 \times 7.5 \times 6.5 \times 5.5 \times 4.5 \times 3.5 \times 2.5 \times 1.5 \times \Gamma(0.5)\). We have \(\Gamma(0.5) = \sqrt{\pi}\), so:

For \(d = 50\):

The ratio becomes astronomically small. Using Stirling's approximation \(\Gamma(n+1) \approx \sqrt{2\pi n}(n/e)^n\):

First dimension where ratio drops below \(10^{-3}\): From the table in the text, \(\text{Ratio}(10) \approx 0.00249\), which is just above \(10^{-3}\). We need to check \(d = 11\):

The ratio first drops below \(10^{-3}\) at \(d = 11\).


Exercise 2. For \(n = 500\) uniformly distributed points in \([0,1]^d\), estimate the expected nearest-neighbor distance \(\mathbb{E}[\min_i \|x - X_i\|] \asymp n^{-1/d}\) for \(d = 2, 10, 50, 100\). At what dimension does this distance exceed half the diameter of the space?

The expected nearest-neighbor distance for \(n\) uniform points in \([0,1]^d\) scales as:

For \(n = 500\):

The diameter of \([0,1]^d\) under the Euclidean norm is \(\sqrt{d}\), so half the diameter is \(\sqrt{d}/2\).

However, the nearest-neighbor distance \(n^{-1/d}\) is measured per coordinate (since we are in \([0,1]^d\)). The Euclidean nearest-neighbor distance scales as \(n^{-1/d} \cdot \sqrt{d}\) (roughly). So the relevant comparison is:

\[ \text{NN distance (Euclidean)} \approx n^{-1/d} \cdot \sqrt{d} \]
\[ \text{Half diameter} = \frac{\sqrt{d}}{2} \]

The ratio is \(2 n^{-1/d}\). This exceeds 1 (i.e., NN distance exceeds half the diameter) when:

\[ 2 n^{-1/d} > 1 \implies n^{-1/d} > 0.5 \implies n < 2^d \]

For \(n = 500\): \(2^d > 500\) when \(d > \log_2 500 \approx 8.97\), so for \(d \geq 9\), the expected nearest-neighbor distance exceeds half the diameter. This confirms that even with 500 points, local methods become meaningless in moderate dimensions because the "nearest" neighbor is nearly as far away as the most distant point.


Exercise 3. Using Stone's minimax rate \(n^{-2\beta/(2\beta+d)}\), compute the effective sample size \(n_{\text{eff}} = n^{(2\beta+1)/(2\beta+d)}\) for \(\beta = 1\) (Lipschitz functions) with \(n = 10{,}000\) observations in dimensions \(d = 1, 5, 20, 100\). Interpret the results for a portfolio with 100 risk factors.

Solution to Exercise 3

The effective sample size is:

\[ n_{\text{eff}} = n^{(2\beta + 1)/(2\beta + d)} \]

For \(\beta = 1\) (Lipschitz functions, \(2\beta = 2\)) and \(n = 10{,}000\):

\[ n_{\text{eff}} = 10000^{3/(2+d)} \]

\(d = 1\):

\[ n_{\text{eff}} = 10000^{3/3} = 10000 \]

Full sample is effective.

\(d = 5\):

\[ n_{\text{eff}} = 10000^{3/7} = 10000^{0.4286} = e^{0.4286 \times \ln 10000} = e^{0.4286 \times 9.2103} = e^{3.948} \approx 52.3 \]

\(d = 20\):

\[ n_{\text{eff}} = 10000^{3/22} = 10000^{0.1364} = e^{0.1364 \times 9.2103} = e^{1.256} \approx 3.51 \]

Interpretation for a portfolio with 100 risk factors: With \(d = 100\) risk factors and \(n = 10{,}000\) observations (about 40 years of daily data), the effective sample size is only 1.3. This means that nonparametric estimation is essentially impossible---there is barely more information than a single observation in one dimension. Any attempt to estimate a nonlinear function of 100 risk factors nonparametrically is futile with this sample size.

This explains why practitioners use parametric factor models (e.g., linear factor models with \(k \ll d\) factors), impose structure like sparsity or additivity, or perform dimensionality reduction via PCA before applying nonparametric methods. Without such structural assumptions, the curse of dimensionality makes learning from data completely infeasible at the scale of typical financial problems.


Exercise 4. A portfolio manager estimates the covariance matrix of \(n = 200\) assets using \(T = 250\) daily returns.

(a) How many free parameters does the covariance matrix have?

(b) Compute the ratio \(\gamma = n/T\). Using the Marchenko–Pastur distribution, find the support \([\lambda_-, \lambda_+]\) of sample eigenvalues when the true covariance is \(I\).

(c) Explain why the smallest sample eigenvalues are biased downward and how Ledoit–Wolf shrinkage addresses this.

Solution to Exercise 4

(a) A symmetric covariance matrix of dimension \(n = 200\) has:

\[ \frac{n(n+1)}{2} = \frac{200 \times 201}{2} = 20{,}100 \text{ free parameters} \]

With \(T = 250\) daily observations, we have 250 data points to estimate 20,100 parameters. The ratio of parameters to observations is \(20{,}100 / 250 = 80.4\), which is extremely underdetermined.

(b) The ratio \(\gamma = n/T = 200/250 = 0.8\).

Under the Marchenko-Pastur distribution, when the true covariance is \(I\) (identity), the sample eigenvalues are supported on:

\[ [\lambda_-, \lambda_+] = [(1 - \sqrt{\gamma})^2, (1 + \sqrt{\gamma})^2] \]

With \(\gamma = 0.8\):

\[ \sqrt{\gamma} = \sqrt{0.8} \approx 0.8944 \]
\[ \lambda_- = (1 - 0.8944)^2 = (0.1056)^2 \approx 0.0112 \]
\[ \lambda_+ = (1 + 0.8944)^2 = (1.8944)^2 \approx 3.589 \]

So the sample eigenvalues spread over \([0.011, 3.589]\), even though the true eigenvalues are all equal to 1.

(c) The smallest sample eigenvalues are biased downward toward \(\lambda_- \approx 0.011\), far below the true value of 1. Similarly, the largest eigenvalues are biased upward toward \(\lambda_+ \approx 3.59\), far above the true value.

This systematic distortion has severe consequences:

  • Overestimation of extreme eigenvalues leads to overestimation of the variance explained by principal components, creating spurious "factors."
  • Underestimation of small eigenvalues leads to ill-conditioning of the sample covariance: \(\text{cond}(S) \approx \lambda_+/\lambda_- = 3.59/0.011 \approx 326\), while the true condition number is 1.
  • Portfolio optimization that inverts the covariance matrix amplifies errors: portfolios load heavily on directions with artificially small eigenvalues.

Ledoit-Wolf shrinkage addresses this by pulling eigenvalues toward a common target:

This shrinks the large eigenvalues downward and the small eigenvalues upward, toward the target \(\mu\) (typically the average eigenvalue). The optimal shrinkage intensity \(\alpha\) is analytically determined to minimize expected Frobenius loss:

\[ \alpha^* = \arg\min_\alpha \mathbb{E}\|\hat{\Sigma}_{\text{LW}} - \Sigma\|_F^2 \]

When \(\gamma = n/T\) is large, \(\alpha^*\) is large (heavy shrinkage), reflecting the greater estimation error. The shrunk covariance matrix has a condition number much closer to the truth, stabilizing downstream applications like portfolio optimization.


Exercise 5. Suppose returns satisfy a sparse linear model with \(s = 5\) truly relevant predictors out of \(d = 500\) candidates. Using the LASSO oracle bound \(\|\hat{\beta} - \beta^*\|_2^2 \leq C \frac{s \log d}{n} \sigma^2\), determine the minimum sample size \(n\) needed to achieve \(\|\hat{\beta} - \beta^*\|_2^2 \leq 0.01\,\sigma^2\).

Solution to Exercise 5

Using the LASSO oracle bound:

\[ \|\hat{\beta} - \beta^*\|_2^2 \leq C \frac{s \log d}{n} \sigma^2 \]

We want \(\|\hat{\beta} - \beta^*\|_2^2 \leq 0.01 \, \sigma^2\). Setting the bound equal to the target:

Solving for \(n\) (and canceling \(\sigma^2\)):

The constant \(C\) depends on the restricted eigenvalue conditions and is typically of order 1 in well-conditioned settings. Taking \(C = 1\):

With a more conservative \(C = 2\) (common in practical bounds):

\[ n \geq 6215 \]

Interpretation: To achieve estimation error of \(0.01 \sigma^2\) with 5 relevant predictors out of 500 candidates, we need roughly 3,000 to 6,000 observations. For monthly financial data, this corresponds to 25 to 50 years---a substantial requirement.

The key insight is that the effective dimension under sparsity is \(s \log d = 5 \times 6.2 \approx 31\), not \(d = 500\). The \(\log d\) factor is the price paid for searching over \(d\) candidates to find the \(s\) relevant ones. This is dramatically better than the nonparametric rate, which would require \(n \asymp \varepsilon^{-(2\beta + d)/\beta}\)---an astronomically large sample size for \(d = 500\).


Exercise 6. Explain why Cover's theorem (random labelings become linearly separable in high dimensions) does not contradict the curse of dimensionality for generalization. Specifically, distinguish between training error and test error in high dimensions and relate this to the concept of overfitting in financial return prediction.

Solution to Exercise 6

Cover's theorem states that for \(n\) points in general position in \(\mathbb{R}^d\), the fraction of possible binary labelings that are linearly separable is \(\frac{1}{2^{n-1}} \sum_{k=0}^{d-1} \binom{n-1}{k}\). When \(d > n\), this equals 1: any labeling is linearly separable.

This does not contradict the curse of dimensionality for the following reasons:

1. Training error vs. test error. Cover's theorem concerns training error: it says that in high dimensions, we can always find a linear classifier that perfectly separates the training data (zero training error), regardless of whether the labels contain any genuine pattern or are pure noise. However, achieving zero training error on noise is the definition of overfitting. The test error (generalization error) on new data will be no better than random guessing when the labels are truly random.

2. Capacity without generalization. The fact that \(2^{n-1}\) possible labelings are all separable means the linear classifier in \(\mathbb{R}^d\) (with \(d > n\)) has massive capacity---it can "memorize" any training set. By standard learning theory (VC dimension), the gap between training and test error grows with model capacity:

\[ R_{\text{test}} \leq R_{\text{train}} + O\left(\sqrt{\frac{\text{VC-dim}}{n}}\right) \]

For a linear classifier in \(\mathbb{R}^d\), \(\text{VC-dim} = d + 1\). When \(d \gg n\), this bound is vacuous (\(> 1\)), meaning zero training error provides no guarantee about test performance.

3. Connection to financial return prediction. In finance, consider predicting the sign of next-month returns (\(Y_t = \pm 1\)) using \(d = 500\) stock characteristics with \(n = 120\) monthly observations. Since \(d > n\), Cover's theorem guarantees we can find a linear classifier that perfectly predicts the sign of training returns. This might produce an impressive in-sample accuracy of 100%.

However, with an \(R^2 \approx 0.25\%\) for monthly returns, the signal is negligible. The perfect in-sample fit is entirely spurious---it has memorized the noise. Out-of-sample, the classifier will have approximately 50% accuracy (no better than a coin flip).

4. The curse remains. The curse of dimensionality is about generalization, not fitting. In high dimensions:

  • Data is sparse (empty space phenomenon)
  • All points are approximately equidistant (distance concentration)
  • The sample covariance is severely distorted (Marchenko-Pastur)

These phenomena all degrade the ability to generalize, even though they do not prevent fitting the training data. Cover's theorem is about the latter; the curse of dimensionality is about the former. They are not in contradiction---they describe different aspects (training vs. testing) of the same high-dimensional learning problem.
